My Machine Learning Pipeline Cheated, and Cross-Validation Never Noticed

https://towardsdatascience.com/my-machine-learning-pipeline-cheated-and-cross-validation-never-noticed/(towardsdatascience.com)
A common, dtype-based machine learning pipeline can produce misleadingly high cross-validation scores while performing poorly on new data. The author demonstrates this by creating synthetic data with four common traps: a leaking ID column, informative missing values, a date stored as text, and a numeric column that should be categorical. While the pipeline reported a 0.98 AUC in cross-validation, its actual performance on a holdout set was only 0.56 AUC, primarily due to the model memorizing the leaking ID and other noise. To address this, the author provides a Python function that automatically audits a dataset to detect these issues and generate plain-English warnings, preventing silent model failure.
